Is it new baby gift's or new baby gifts? My instinct is the latter but the more I think about it the more confused I'm getting.

It depends what you want to say.
The apostrophe is needed when there's some letter(s) missing (represented by the apostrophe), or when there's something "belonging" to the word in front of the apostrophe. It is NOT needed when the s is there just to make a plural.
So, the following are all correct:
The baby gift's not what we expected - the apostrophe shows where "gift is" has been shortened. The baby gift's box was ripped open - the apostrophe shows that we mean the box OF the gift. The baby gifts were splendid - it's just more than one gift, so no need for an apostrophe.
